Particularly in larger companies, there has been a noticeable return to requiring workers to work from the office following the COVID-19 pandemic. [Mark Ma](https://business.pitt.edu/professors/mark-ma/), an associate professor of business administration at the Joseph M. Katz Graduate School of Business at the University of Pittsburgh, and Yuye Ding, a PhD student, have[ investigated this pattern](https://papers.ssrn.com/sol3/papers.cfm?abstract_id=4675401). They have looked at the sociological and economic effects of working remotely as well as the recent initiative by businesses to get workers back into the office, which frequently irritates workers.

The apex of this tendency appears to have passed, even though several businesses required employees to return to the office following the pandemic. According to surveys done in 2024, the majority of CEOs no longer place a high value on being at the office. Businesses learned that workers might be quite productive when working remotely during the pandemic. But other managers still have misgivings about working remotely, which is why they are advocating for going back to the office. Employee morale may suffer as a result of this lack of trust since it conveys to staff members that their managers do not believe in them.

Modern Deep Neural Networks (DNNs) are intrinsically opaque, making it challenging to comprehend their decision-making processes. This lack of transparency interferes with the extensive implementation of Machine Learning techniques in a variety of domains. In response, Explainable AI (XAI) has surfaced intending to improve human comprehension of DNN judgments. By looking at the functional purpose of each component, XAI now also focuses on understanding the global behavior of DNNs, in contrast to local explanation methods that employ saliency maps to explain individual predictions.

Mechanistic interpretability is a global explainability technique that focuses on pinpointing the particular ideas that neurons, the fundamental computing units of a neural network, have acquired the ability to understand. We can explain the operation of a network's latent representations by labeling neurons with descriptions that are comprehensible to humans. These descriptions have progressed from simple labels to elaborate, compositional, and open-vocabulary explanations. Nevertheless, the lack of standardized quantitative metrics for assessing these open-vocabulary descriptions has hindered thorough comparisons across various approaches.

To address this gap, researchers from ATB Potsdam, University of Potsdam, TU Berlin, Fraunhofer Heinrich-Hertz-Institute, and BIFOLD introduce [CoSy](https://arxiv.org/abs/2405.20331), a pioneering quantitative evaluation framework for assessing the use of open-vocabulary explanations in computer vision (CV) models. This innovative method makes use of developments in Generative AI to produce artificial images that correlate to concept-based textual descriptions. CoSy eliminates the need for human interaction by facilitating quantitative comparisons of different concept-based textual explanation approaches by synthesizing data points common for particular target explanations.

The research team demonstrated through an extensive meta-analysis that CoSy offers reliable evaluations of explanations. The study discovered that concept-based textual explanation methods function best in the upper layers of neural networks, where high-level concepts are learned. High-quality neuron explanations are produced by methods such as INVERT, which creates visuals from neural network representations, and CLIP-Dissect, which examines internal network representations. Conversely, techniques such as MILAN and FALCON produce explanations of inferior quality, occasionally providing almost random concepts, which may result in inaccurate network conclusions.

A major drawback of CoSy, as the researchers recognize, is that specific categories from the training data might not have been included in the generative model, leading to explanations that are too general or ambiguous, such as "white objects." Generative accuracy might be increased by addressing this problem by examining pre-training datasets and model performance. Even yet, CoSy exhibits much potential in the still-developing field of assessing non-local explanation techniques.

Looking ahead, the team is hopeful about CoSy's potential applications across multiple fields. To evaluate the plausibility or quality of an explanation concerning the result of a downstream task, human judgment must be included in the definition of explanation quality, which they want to address in future work. Additionally, they want to include additional fields like natural language processing and healthcare in their evaluation system. The potential use of CoSy for assessing large, opaque, autointerpretable language models (LLMs) is especially exciting. According to the researchers, applying CoSy to healthcare datasets, where explanation quality is important, could be a big step forward. Understanding Neural Networks: CoSy's Quantitative Framework for Textual Explanation Evaluation

[Transformer-based models](https://blogs.nvidia.com/blog/what-is-a-transformer-model/) are famous for their ability to parse and interpret complex text. They rely on understanding the order and context of words - tasks at which traditional positional encoding methods have shown their limits. Addressing this gap, the ROFORMER model, powered by the **Rotary Position Embedding (RoPE)**, redefines our approach to positional encoding.

## Traditional Positional Encoding

Transformers treat text as a series of tokens, and allow **parallel processing of sequences** for greater efficiency. However, this strength brought its challenge: the **model's inherent agnosticism to token order**. **Positional encoding** was the answer, **providing each token a unique signature denoting its sequence position**.

### Absolute Position Embeddings

Initially, models like BERT used **absolute position embeddings, assigning a fixed vector to each position in a sequence**. This method, though straightforward, inherently **lacks the ability to adapt to sequence length variations, or to emphasize the relative distances between tokens**, critical for understanding many linguistic constructs.

### Relative Position Embeddings

To capture the dynamic nature of language, relative position embeddings were introduced, focusing on the distance between tokens rather than their absolute positions. Despite their conceptual advantage, these embeddings introduced **computational complexity, and failed to seamlessly integrate into the self-attention mechanism of Transformers**, limiting their efficacy.

## ROFORMER and Rotary Position Embedding

Recognizing the limitations of existing positional encoding strategies, ROFORMER introduces Rotary Position Embedding (RoPE), an approach that combines the benefits of absolute and relative position information without their respective drawbacks.

### Rotary Position Embedding

RoPE encodes positional information using **rotation matrices**, enabling the model to understand not just where a token is, but how it relates to every other token in a sequence.

### Implementing RoPE

Implementing RoPE involves encoding each token's position into a rotation matrix, and applying this matrix within the self-attention mechanism of the Transformer. This process allows for a flexible, dynamic interpretation of positional information, accommodating varying sequence lengths and capturing the essence of token interrelationships without significant computational overhead.

First, you'll need a function to generate the rotary embeddings, and then you'll integrate these embeddings into your model. The example below assumes you're familiar with creating custom layers in Keras.

#### Step 1: Define the Rotary Embedding Function

This function generates the rotary embeddings given the maximum sequence length, and the dimensionality of the embeddings.

In details:

- `tf.range(0, dim, 2, dtype=tf.float32)` creates a range of values starting from 0 up to `dim` (exclusive), stepping by 2. The `dtype=tf.float32` argument specifies that the elements of this tensor are 32-bit floating-point numbers. If `dim` is 8, for example, this would produce `[0, 2, 4, 6]`.

- The tensor produced by `tf.range` is then divided by the dimensionality (`dim`) of the embeddings. This operation scales these indices down to a range between 0 and 1 (exclusive if `dim` is even, slightly inclusive if `dim` is odd, because the range step skips every other value). Continuing the example with `dim` = 8, dividing by 8 yields `[0.0, 0.25, 0.5, 0.75]`.

- The `10000 ** (...)` operation raises 10,000 to the power of each element in the previously scaled tensor. The base of 10,000 is somewhat arbitrary, but is chosen to ensure that the frequencies vary over a wide range, which helps the model to differentiate between different positions more effectively. For `[0.0, 0.25, 0.5, 0.75]`, it would apply the power operation to each, resulting in values much larger for higher elements.

- Finally, the inverse frequency is obtained by taking the reciprocal (1/x) of the values from the previous step. The inverse frequencies are smaller for higher indices, meaning elements further in the sequence will have smaller frequencies, affecting how their positions are encoded into the model. This allows the embeddings to scale in a manner where relative positions can be inferred through the model's attention mechanisms.

The concatenation ensures that each positional encoding contains both sine and cosine information, which allows the preservation of information about both the amplitude and phase of the positional signals.

- The concatenated tensor `emb` now holds the complete rotary embeddings for the input positions. The shape of `emb` will be the same as `freqs` in its first two dimensions (corresponding to sequence positions and embedding dimensions), but its last dimension will be twice as large, accounting for both sine and cosine values. These embeddings are used to modulate the input embeddings by adding positional information in a rotationally equivariant manner.

1. The first colon `:` means "select all elements in this dimension," which, in this case, refers to all positions in the sequence.

2. `None` is used to add an additional dimension, making the tensor 3-dimensional. This is often done to ensure compatibility with certain operations that expect inputs of a specific number of dimensions. For instance, when performing element-wise multiplication with another tensor that is 3-dimensional, the shapes must align according to broadcasting rules.

3. `:self.dim // 2`, selects the first half of the dimensions in the last axis. Since the `embedding_dimension` is doubled to include both sine and cosine values, dividing by 2 effectively selects just the cosine components of the embeddings.

#### Step 3: Integration with a Keras Model

After defining the `RotaryEmbeddingLayer`, you can integrate it into your Keras model. This layer should be applied to your embeddings before feeding them into attention layers or any subsequent model layers.

However, they fail at a seemingly straightforward task: reversing learned facts. This limitation, termed the "Reversal Curse," implies that LLMs cannot deduce that "B is a feature of A" from learning "A has a feature B," a basic reasoning skill that even children possess. This paper introduces "Reverse Training," a novel method to address this challenge by leveraging a dual-direction training approach to enhance the model's comprehension of facts in both forward and reverse formats.

## The Origins of the Reversal Curse

The problem arises from the fundamental training approach of LLMs, which typically involves **autoregressive, left-to-right learning**. This method does not inherently teach the models to understand or generate information in the reverse order. Given the nature of data distribution following Zipf's law, many facts are only mentioned in one direction, exacerbating this issue. The "Reversal Curse" limits the LLMs' understanding of reciprocal relationships and equivalence in statements, marking a significant shortcoming in their reasoning capabilities.

## Overcoming the Reversal Curse with Reverse Training

The proposed solution, Reverse Training, doubles the available training data by including both original and reversed versions of training strings. The reversal process is careful not to alter certain substrings, such as entity names, maintaining their original sequence to preserve context. This method, akin to introducing a second language for the LLM to learn, significantly improves the model's ability to process and generate information in both directions.

## Testing the Reverse Training Method

The authors conducted the following experiments to test their proposed method:

Across these experiments, Reverse Training not only mitigated the Reversal Curse but, in some cases, completely eliminated it. The method proved particularly effective when entity names were preserved in their original order during the reversal process, highlighting the importance of maintaining certain contextual anchors.

The success of Reverse Training in addressing the Reversal Curse opens new avenues for LLM training methodologies.
